I personally use the Eco wheel cleaner (the normal wheel cleaner would probably be too harsh imo) when they start getting bad but soap and water should also do the trick.
I don't know if I told you, but I bought a set of the "Woolies" and they are very good at cleaning every part of the wheel. It's still time consuming, but it sure saves the knuckles.
